So I looked under this jeep this morning and looks like my reaf diff is leaking. I don't notice anything actually on the ground but the cover is wet. So my question is, time to get new ones or figure out how to get this one fixed?

The dark color on the bottom left side seems to be where it is leaking

Well, you can see if the bolts need to be tightened. If so, then you could have hit the cover and tweaked it a little, causing them to leak. Covers usually go for $100 soooooooo, if you have to take the covers off because of the leak, then I would just upgrade to new ones.
But, check the bolts first.

I know I banged it a few times over the weekend. Ok I'll go check the bolts now. If not, guess I know what I'm doing tomorrow!
You can either, pull and clean up the factory cover (I would sand and paint black again) and either re RTV or buy lube lockers. Another option is to Use this as an excuse to get new covers and lube lockers
After the first time I went wheeling, the first thing I needed to do was replace my diff cover after noticing a leak similar to yours.
In my opinion, it makes a lot more sense to replace it with an aftermarket solution rather than spending the time on the stock one. Why? Because it will likely leak again, and then you'll have to fix it again. And the peace of mind is well worth it.
